Why predictive maintenance so often disappoints

Predictive maintenance is one of the most talked-about concepts in industrial digitalization. The idea is compelling: machines that anticipate their own failures before they occur, service that becomes proactive, maintenance planned on data rather than fixed time intervals.

For OEMs, it sounds like a natural next step. Machines already have sensors. They already generate data. Surely it's just a matter of building the right algorithms.

But many organizations hit an unexpected wall when they actually try to implement it. The promised insights don't appear. Models are hard to train. Predictions stay unreliable. Or the system generates so many alerts that teams stop taking them seriously.

The problem is rarely the algorithms.

It almost always starts much earlier.

The missing foundation

Predictive maintenance assumes that historical data contains enough context to recognize patterns that precede failures. When a component gradually degrades, that behavior should be visible in sensor values or events that occurred before the breakdown.

But for that to work, the data first needs to be reliable and interpretable.

In many installed bases, that is not a given. Machines generate log data, but that data often lacks structure. Sensor values are stored without clear asset context. Alarm codes are inconsistent across installations. Events are not always recorded — or get overwritten.

When engineers dig into historical data, they find that critical events are simply missing or too ambiguous to use.

At that point, predictive maintenance has nothing to work with but noise.

Why data becomes inconsistent over time

The cause usually lies in how machines evolve in practice.

An installation starts with a relatively clear configuration. But over its lifetime, small changes accumulate. Software updates are applied. New sensors are added. Parameters are adjusted to optimize the process.

Each change shifts the context of the data.

When that context is not explicitly recorded, historical data loses part of its meaning. A sensor value from three years ago may have been measured under a different configuration than today. An alarm code may mean something different across software versions.

For a human, that can sometimes still be reconstructed. For an algorithm, it becomes a serious problem.

What predictive models actually need

A predictive model only works when it understands what it is observing.

When a sensor value rises, the system needs to know which asset it belongs to, under what conditions it was measured, and how it relates to earlier events. That requires a consistent structure around assets and events.

Every machine needs a clear identity. Sensor values must remain linked to that asset. Events — faults, maintenance activities, configuration changes — must be connected chronologically.

Without that structure, a model sees data but not context. And without context, pattern recognition becomes guesswork.

Logging matters more than algorithms

When you look at predictive maintenance projects that actually work, the same pattern keeps appearing. The biggest investment was not in building algorithms. It was in organizing data.

Teams first focused on consistent logging. Machines got clear asset identities. Events were systematically recorded. Historical data was cleaned and structured.

Only then did model development begin.

That sequence may sound less exciting than training advanced algorithms, but it turns out to be decisive. Predictive maintenance is ultimately nothing more than pattern recognition in historical events. When those events are incomplete or inconsistent, reliable patterns cannot be found.

The same foundation improves daily service

There is an important side effect worth noting.

The same data foundation that enables predictive maintenance also makes everyday service significantly better. When asset identities, events, and sensor values are consistently logged, service engineers have a much clearer picture of what is happening in an installation. Troubleshooting becomes faster because events around a fault remain visible in the machine's historical context.

What starts as preparation for predictive maintenance turns out to also be the basis for better remote service. The organization understands its installed base more deeply — before a single predictive model is ever deployed.

The role of Capture
